The field of diffusion models is advancing with the introduction of Soft Value-Based Decoding (SVDD), a novel algorithm that enhances guidance in both continuous and discrete diffusion models without relying on derivatives. This method addresses limitations in traditional approaches, maintaining the robustness and efficiency of pre-trained models.

📌 Enhanced Guidance with Importance Sampling: SVDD improves the guidance in diffusion models by using importance sampling (IS) (A technique used to improve the accuracy of estimates by sampling from a distribution that is easier to work with) to better approximate soft-optimal policies and ensure sample efficiency. Unlike the Best-of-N approach, which selects the best samples from a set, IS integrates soft value functions (These functions provide a measure of how good a sample is in a less rigid, more flexible way than traditional methods) to provide more accurate guidance.
📌 SVDD Algorithm and Learning Methods: The SVDD algorithm enhances sample quality without needing extra training by using soft value functions. It includes two learning methods: Monte Carlo regression (SVDD-MC)(A method for estimating value functions by averaging results from multiple random samples, providing stability), which ensures stability, and posterior mean approximation (SVDD-PM)(An approach that estimates value functions based on the average of predictions from pre-trained models, eliminating the need for additional training), which leverages pre-trained models to estimate value functions efficiently.
📌 Performance and Practicality: SVDD simplifies integration by avoiding the need for model fine-tuning, reducing the risk of over-optimization, and proving effective in various tasks such as image generation and molecule design. However, it might require more computational resources and relies on pre-trained models.
