ABSTRACT

Detection and recognition of traffic signs are very important and could potentially be used for
driver assistance to reduce accidents and eventually in driverless automobiles. Also traffic
signals are essential part of day to day lives. They contain critical information that ensures the
safety ofall the people.

As there are number of traffic signs throughout the world, it is almost impossible for human
beings to remember them and identity their meaning which create huge traffic accidents and
human loss throughout the world so it is important to establish this project that will remember the
traffic signs of all the country throughout the world.

Traffic signs classification is the process of identifying which class a traffic sign belongs to. In
this project with the help of deep learning, different traffic signs are identified and classified into
different categories which helps in reducing various traffic accidents and also reduces human
time to remember different traffic signs.

In this project, traffic sign recognition using Convolutional Neural Network (CNN) is
implemented, the CNN will be trained by using GTSRB dataset of 43 different classes containing
50,000 images of traffic signs the results will show 94% accuracy. Keywords: Convolutional
Neural Network, Traffic Sign Recognition, Tensor flow and Keras Model.

1. 1. INTRODUCTION

Traffic sign detection and recognition has gained importance with advances in image process thanks to
the advantages that such a system could give. The recent developments and interest in self-driving cars
has conjointly exaggerated the interest during this field. A traffic sign detection and recognition system
can give the flexibility for good cars and good driving. In self-driving cars, many passengers fully
depend on the car for traveling. But to achieve level 5 autonomous, it is necessary for vehicles to
understand and follow all traffic rules. In the world of Artificial Intelligence and advancement in
technologies, many researchers and big companies like Tesla, Uber etc. are working on autonomous
vehicles and self-driving cars. So, for achieving accuracy in this technology, the vehicles should be able
to interpret traffic signs and make decisions accordingly. Without traffic signs, all the drivers would be
clueless about what might be ahead to them and roads can become a mess. The annual global roach crash
statistics say that over 3,280 people die every day in a road accident. These numbers would be much
higher in case if there were no traffic signs. On the other hand, researchers and big companies are
working extensively on proposing solutions to self-driving cars like Tesla, Uber, Google, Audi, BMW,
Ford, Toyota, Mercedes, Volvo, Nissan, etc. These autonomous vehicles need to follow the traffic rules
and for that, they have to understand the message conveyed through traffic signs.
1.1 MOTIVATION

Traffic Sign Classification is employed to detect and classify traffic signs to inform and warn a driver
beforehand to avoid violation of rules. There are certain disadvantages of the existing systems, used for
classification, like incorrect predictions, hardware cost and maintenance, which is to a great extent
resolved by the proposed system. The proposed approach implements a traffic signs classification
algorithm employing a convolutional neural network. Also, it consists of the feature of web cam detection
of the traffic sign. This will help the driver to observe the sign close to his / her eyes on the display screen
and thus save his/her time in manually checking the traffic sign each time.

1.2 PROBLEM DEFINITION

Traffic Signs Classification is an important task for self-driving cars. In this Project, I have prepared a
Deep Convolutional Neural Network Model which can classify the images of 43 distinct types of Traffic
Signals. It is a multi-class Classification Project. You can gain insights about the Implementation of Deep
Convolutional Neural Network in Image Classification.

1.3 OBJECTIVE OF THE PROJECT

The objective of this project is that Traffic signs classification is the process of identifying which class a
traffic sign belongs to. The goal of the Traffic Sign Recognition is to build a deep neural network model
that can classify traffic signs present in the image into different categories. With this model, different
traffic signs are read, understand and classified into different classes which are a very important task for
all autonomous vehicles. The earlier Computer Vision techniques required lots of hard work in data
processing and it took a lot of time to manually extract the features of the image. Now, deep learning
techniques have come to the rescue and using this traffic recognition system for autonomous vehicles is
build.
1.4 LIMITATIONS

Although, there are many advantages of traffic sign classification, there are certain difficulties as
as well. It may happen that the traffic sign is hidden behind the trees or any board at the road side

which may cause the inaccurate detection and classification of traffic sign. Sometimes it may
happen that the device went so fast, that it did not detect the traffic sign. This may be dangerous

and can lead to accidents. There is a need for further research to deal with these issues.
2. PROBLEM STATEMENT

Autonomous vehicles require precise and rapid interpretation of traffic signs to operate safely. Traditional
methods for traffic sign classification often face challenges such as low accuracy, high computational

costs, and difficulty in handling diverse real-world conditions (e.g., lighting variations, occlusions). The
problem addressed in this project is the need for a reliable, efficient, and scalable system for traffic sign

classification that can improve on these limitations. The goal is to develop a model capable of accurately
recognizing and categorizing traffic signs under various conditions, supporting advancements in safe and

efficient autonomous driving.


3. LITERATURE SURVEY

Literature survey is the most important step in software development process. Before developing the tool
it is necessary to determine the time factor, economy and company strength. Once these things are
satisfied, then next step is to determine which operating system and language can be used for developing
the tool. Once the programmers start building the tool the programmers need lot of external support.
This support can be obtained from senior programmers, from book or from websites. Before building
the system the above considerations are taken into account for developing the proposed system.

A literature review is a body of text that aims to review the critical points of current knowledge
including substantive findings as well as theoretical and methodological contributions to a particular
topic. Literature reviews are secondary sources, and as such, do not report any new or original
experimental work. Also, a literature review can be interpreted as a review of an abstract
accomplishment.
4. EXISTING SYSTEM

In the area of traffic sign detection and recognition, a considerable amount of work has been put
forward. As two global characteristics of traffic signs, several authors concentrated on the color
and shape attributes of image for detection. These features can be used to detect and trace a moving
object in a series of frames.
This approach is helpful when the target to be identified is a special color that is distinct from the
background color. To detect an object with a certain shape, object borders, corners, and contours
may be used. How ever authors only focused on the detection and recognition measures, ignoring
the voice feature, which is an essential driver warning system.
In addition, hyper parameter tuning has received less attention. As a result, the proposed system
wouldconcentrate on different parameters of the CNN algorithm in order to improve accuracy
without requiring additional computing resources. In most of the existing systems recognition
accuracy is heavily dependent on the quality of the input document. In Most of the existing
systems focus on detection only. Detection is mainly the extraction of features and find out the
important coordinatesin the image. Classification is the categorization of image into different
classes.
The existing system for traffic sign detection and recognition has a few primary methods and
limitations:

1. Detection Focus: Most existing systems emphasize the detection aspect—locating and
identifying traffic signs based on distinctive visual features like color and shape. By analyzing
colors (e.g., red for stop signs) and shapes (e.g., triangles, circles), these systems can recognize
traffic signs under certain conditions. For instance, in a series of frames, the system may
identify moving objects or distinctive colors that contrast with the background.

2. Limited Classification Ability: Although these systems can detect signs, they often do not
excel in categorizing them into detailed classes, which limits their functionality for complex
autonomous driving needs.

3. Hardware Dependency: Existing systems often depend heavily on high-quality hardware and
specific image processing capabilities, which increases maintenance and hardware costs. When
image quality or sensor conditions deteriorate, the system’s accuracy may decline.

4. Challenges in Handling Real-World Variability: Current systems struggle with complex, real-
world variables. For instance, the system’s accuracy can be affected by environmental factors
like poor lighting, weather, and partial occlusion of signs (e.g., a sign being obscured by a tree
or another object). These factors make detection unreliable in some scenarios.

5. Lack of Voice Feature and Hyperparameter Tuning: The existing methods lack an integrated
voice warning system, which would alert drivers of detected signs. Additionally, the tuning of
hyperparameters—settings that control the learning process—is often neglected, which limits
the model’s potential accuracy and efficiency.

6. Detection without Classification: Many current systems excel at detection but do not perform
full classification, which means they may identify a traffic sign’s presence but cannot always
categorize it accurately into specific sign classes. This distinction is important for autonomous
vehicles, which require precise understanding of signs to make accurate driving decisions.

4.1 DISADVANTAGES OF EXISTING SYSTEM

The existing system for traffic sign detection and recognition has several notable disadvantages, which
the proposed system aims to address. These limitations affect its performance, usability, and reliability
in real-world applications. Here’s a detailed look at these disadvantages:

1. High Complexity: Existing systems often rely on complex image processing techniques to detect and
classify traffic signs based on color and shape attributes. These techniques can require extensive
preprocessing steps, such as filtering, edge detection, and shape analysis, which increases the
complexity of the system. This complexity can make the system slower and more difficult to
optimize, especially in real-time applications like autonomous driving.

2. Limited Accuracy: Accuracy in existing systems is often highly dependent on the quality of the input
image. Factors like low lighting, weather conditions, or motion blur can significantly impact the
system’s ability to detect and classify traffic signs accurately. As a result, existing systems can
struggle to provide reliable and consistent results across a range of environmental conditions, which
limits their practical effectiveness in real-world scenarios.

3. Dependency on Image Quality and Conditions: Existing systems typically use basic image
processing techniques that struggle to adapt to varying conditions, such as shadows, partial
occlusions (e.g., signs blocked by trees or other objects), and different lighting conditions. This
reliance on ideal conditions limits the system’s effectiveness in dynamic environments where signs
may be obscured or where lighting changes frequently. As a result, accuracy can drop significantly
in less-than-ideal conditions, which is a critical disadvantage in autonomous driving.

4. Higher Computational Costs: Many traditional traffic sign recognition systems require complex
algorithms that process each frame individually to detect specific colors and shapes. This can lead to
high computational costs, especially when implemented on devices with limited hardware resources,
like onboard computers in vehicles. As the computational demands rise, the system may require
additional hardware support, which increases costs and can limit deployment in cost-sensitive
applications.

5. Time Consumption: Due to the step-by-step nature of image processing tasks (e.g., color
segmentation, shape detection), existing systems can be time-consuming, especially when working
with high-resolution images or fast-moving traffic scenes. This can limit the system’s
responsiveness, particularly in real-time applications where fast decision-making is crucial. This
time lag can pose safety concerns in applications like driver-assist systems, where delays in
recognizing traffic signs can affect vehicle response times.

6. Lower Adaptability to Diverse Conditions: Existing systems are often designed for specific
conditions or types of traffic signs and may not generalize well to different regions or conditions.
For instance, traffic signs vary widely in color, shape, and symbols across countries, but traditional
systems may not be adaptable enough to handle these variations without extensive modifications.
This lack of adaptability limits the system’s usefulness in global applications, such as autonomous
vehicles that operate in multiple countries.

7. Limited Focus on Classification: Many existing systems primarily focus on detecting the presence of
traffic signs but may not have robust classification capabilities to categorize each sign accurately.
This means they can often recognize that a sign is present but might struggle to identify its specific
type (e.g., speed limit vs. stop sign) reliably. This lack of detailed classification limits the system’s
utility, as autonomous vehicles require precise categorization to follow traffic rules accurately.

8. Lack of Voice Alerts and Driver Warnings: While detection and classification are essential, existing
systems often lack additional features, such as voice alerts or driver warnings, which could enhance
driver awareness and response times. This limitation reduces the system’s effectiveness as an
assistive tool for drivers and could lead to missed warnings if the driver does not see the detected
sign visually.

9. Minimal Hyperparameter Tuning: Traditional image processing-based methods don’t typically


benefit from the hyperparameter tuning that deep learning models allow. In machine learning,
adjusting hyperparameters (such as learning rate, batch size, etc.) helps optimize model performance.
Existing systems are often static, lacking the flexibility to fine-tune their parameters, which limits
their ability to improve accuracy and efficiency.

10. Hardware Dependency and Maintenance Costs: Many traditional systems rely on specialized
hardware to perform the necessary image processing tasks. This dependency increases the overall
cost of deployment, as additional hardware may be needed to ensure effective recognition of traffic
signs. Furthermore, these systems require regular maintenance to stay accurate and efficient, adding
to their long-term operational costs.
In summary, the existing systems for traffic sign detection and recognition suffer from limitations in
accuracy, speed, adaptability, and computational efficiency. These systems struggle to adapt to varying
environmental conditions and require high-quality input data, which limits their effectiveness in real-
world applications, especially in dynamic settings like autonomous driving. The proposed system aims
to overcome these limitations by leveraging deep learning techniques that improve accuracy, reduce
computational costs, and allow better adaptability across different conditions and regions.

PROPOSED SYSTEM

The proposed system for traffic sign classification aims to address the limitations of traditional
methods by leveraging deep learning, specifically Convolutional Neural Networks (CNNs). This
advanced approach improves accuracy, adaptability, and computational efficiency, making it well-
suited for real-world applications, including autonomous driving. Here’s a detailed explanation of the
system’s components, processes, and advantages:

1. Core Technology: Convolutional Neural Network (CNN)

CNNs are a type of deep learning model particularly effective for image recognition tasks. They
consist of multiple layers (convolutional, pooling, and fully connected layers) that process image data
by learning features such as edges, shapes, and textures, gradually building a high-level
understanding of images.

In this system, CNNs are used to classify traffic signs accurately by training on a large dataset of
labeled images. This helps the model recognize various sign classes (e.g., stop, yield, speed limit
signs) with high precision.

2. Dataset Used: German Traffic Sign Recognition Benchmark (GTSRB)

The system is trained on the GTSRB dataset, which is widely used in traffic sign classification
research. This dataset contains over 50,000 images across 43 different classes of traffic signs,
captured under real-world conditions, such as varying lighting, weather, and partial occlusions.

The dataset’s diversity allows the system to learn and generalize well, helping it recognize signs in
challenging conditions similar to those encountered in real-world driving scenarios.

3. Preprocessing Steps

Image Resizing: All images are resized to a standard size (e.g., 30x30 pixels) to ensure consistency
and reduce computational complexity.

Normalization: The pixel values are normalized to ensure faster convergence during training.
Normalization helps the model learn more effectively by maintaining uniform data ranges.

Label Encoding: Each image in the dataset is labeled with a corresponding traffic sign class. A CSV
file with class labels and IDs allows the model to associate each image with the correct class during
training.

Data Augmentation: To enhance model generalization, data augmentation techniques (like rotation,
flipping, and color adjustments) can be applied. This step generates variations in training images,
helping the model adapt to different viewing angles and lighting conditions.

4. Model Architecture

The CNN model is composed of several layers:

Convolutional Layers: Extract feature maps from images by applying filters, which detect edges,
textures, and other patterns.

Pooling Layers: Reduce the spatial dimensions of feature maps, which minimizes computational load
while retaining important information.

Fully Connected Layers: Perform the final classification by connecting all neurons to each other,
allowing the model to interpret the learned features and assign class labels.
Dropout Layers: Dropout regularization is used to prevent overfitting by randomly dropping a
fraction of neurons during training, forcing the model to generalize better.

5. Training Process

The model is trained on the GTSRB dataset with labeled data. During training, the CNN model learns
patterns that help it identify and classify traffic signs accurately.

Loss Function: A categorical cross-entropy loss function is used, which calculates the difference
between the predicted and actual class probabilities, guiding the model to minimize classification
errors.

Optimization Algorithm: Stochastic Gradient Descent (SGD) or other optimizers (e.g., Adam) are
used to adjust the model’s weights based on the calculated loss, improving the model’s accuracy over
time.

6. Classification and Real-Time Detection

After training, the model can classify traffic signs in real-time. A webcam or camera sensor can
capture traffic signs, which are then processed by the CNN model to determine the class of each
detected sign.

The model outputs the class label of each traffic sign detected, allowing autonomous vehicles or
driver-assist systems to respond appropriately (e.g., slow down near a stop sign, yield at an
intersection).

7. Output and Interpretation

Once a traffic sign is classified, the system can display the identified sign’s name on a screen or, in
autonomous applications, trigger appropriate responses in the vehicle’s control system.
A voice alert feature can be integrated to warn drivers of upcoming signs, further enhancing the
system’s utility as a driver-assist tool.

8. Advantages of the Proposed System

High Accuracy: CNN models generally outperform traditional image processing methods in terms of
classification accuracy, as they can learn intricate patterns directly from the data.

has input screens in almost all the modules. Error messages are developed to alert the user whenever he

commits some mistakes and guides him in the right way so that invalid entries are not made. Let us see

deeply about this under module design. Input design is the process of converting the user created input

into a computer-based format. The goal of the input design is to make the data entry logical and free from

errors. The error is in the input are controlled by the input design. The application has been developed in

user-friendly manner. The forms have been designed in such a way during the processing the cursor is

placed in the position where must be entered. The user is also provided with in an option to select an

appropriate input from various alternatives related to the field in certain cases. Validations are required

for each data entered. Whenever a user enters an erroneous data, error message is displayed and the user

can move on to the subsequent pages after completing all the entries in the current page.
7.1 OUTPUT DESIGN

The Output from the computer is required to mainly create an efficient method of communication

within the company primarily among the project leader and his team members, in other words, the

administrator and the clients. The output of VPN is the system which allows the project leader to

manage his clients in terms of creating new clients and assigning new projects to them, maintaining

a record of the project validity and providing folder level access to each client on the user side

depending on the projects allotted to him. After completion of a project, a new project may be assigned

to the client. User authentication procedures are maintained at the initial stages itself. A new user may

be created by the administrator himself for a user can himself register as a new user but the task of

assigning projects and validating a newuser rests with the administrator only. The application starts

running when it is executed for the first time. The server has to be started and then the internet explorer

in used as the browser. The project will run on the local area network so the server machine will serve

as the administrator while the other connected systems can act as the clients. The developed system is

highly user friendly and can be easily understood by anyone using it even for the first time.

1. Data Preprocessing

In this module, GTSRB is a very famous international database of road signs. In order to train and test
the model, some research projects [38] used this database. GTSRB contains 43 kinds of road signs,

training and test images taken under real conditions, as shown in Figure 5, a total of more than 50,000
images. In this step, ‘train’ folder contains 43 folders each representing a different class. The range of

the folder is from 0 to 42. With the help of the OS module, iterate over all the classes and append
images and their respective labels in the data and labels list. The PIL library is used to open image
content into an array. Stored all the images and their labels into lists (data and labels). Convert the list

into NumPy arrays for feeding to the model. The shape of data is (39209, 30, 30, 3) which means that
there are 39,209 images of size 30×30 pixels and the last 3 means the data contains colored images

(RGB value). With the ski-learn package, use the train_test_split() method to split training and testing
data. From the keras.utils package, use to categorical method to convert the labels present in y_train

and y_test into one-hot encoding.

3. Expanded Dataset for Benchmarking: Increasing the dataset size and sharing it publicly would
support benchmarking, allowing other researchers to compare models and advance this
technology.

15. CONCLUSION

The Proposed System is designed to detect a method for automatic fine-grained recognition of traffic
signs is presented. The classification process is carried out by using a single CNN that alternates
convolutional and spatial transformer modules. To find out the best CNN architecture, several empirical
experiments are conducted in order to investigate the impact of multiple spatial transformer network
configurations within the CNN, together with the effectiveness of four stochastic gradient descent
optimization algorithms. The CNN model outperforms all previous state-of-the-art methods and
achieves a recognition rate accuracy of 99.71% in the GTSRB, and it is therefore currently top-1 ranked.
Furthermore, our proposed approach needs no hand-crafted data augmentation and jittering used in prior
work (Ceresin et al., 2012; Jin et al., 2014; Sermonette & Lacuna, 2011). Moreover, there are fewer
memory requirements and the network has a lower number of parameters to learn compared with
existing methods since the use of several CNNs in a committee or in an ensemble is avoided. Although
our method is ranked in the top positions of the German and Belgian datasets, there have been several
recent releases of publicly available traffic sign recognition datasets: these have not yet been tested
since they are less established than previous datasets. Nevertheless, to the best of our knowledge, no
other scientific paper analyses the use of several STNs and the comparison of stochastic gradient descent
optimizers in the traffic sign classification problem domain. These experiments and their results can help
other researchers to apply this new proposal to these new datasets.

In this research workman efficient traffic sign detection and recognition system is developed. The dataset
went through a preprocessing, building CNN model and training and testing stages. It got partitioned
into training, testing and validating datasets. The final Deep CNN architecture proposed in this work
consists of two convolutional layers, two carpooling layers, three dropout layer and 2 dense layers.
We have successfully classified the traffic signs classifier with 94% accuracy in 20 epochs and visualized
how our accuracy and loss changes with time, which is pretty good from a simple CNN model. The
techniques implemented in this research can be used as a basis for developing general purpose, advanced
intelligent traffic surveillance systems future work will include increasing the size of the dataset and
publishing it so that it can be used by other researchers for benchmarking purposed.
