What are the current and potential applications of qubits in artificial intelligence and machine learning?

Qubits have significant potential in AI and machine learning, enhancing computational power and efficiency. Currently, quantum machine learning algorithms, like quantum support vector machines and quantum neural networks, leverage qubits to solve complex problems faster, with applications in areas such as natural language processing and image recognition. In the future, qubits could revolutionize AI by enabling more efficient training of large-scale models, faster data processing, and tackling problems like drug discovery and optimization. Their ability to exploit quantum superposition and parallelism offers new possibilities for AI and ML advancements.

In current discussions there is always the argument - in Qubits vs. (classical) Bits - that Qubits could store more/different information and be more expressive than bits and that quantum mechanical effects will lead to huge impacts and improvements (as shown in theory). But currently we are limited in the amount of physical qubits available (<1000) vs bits (>= billions,...). And also there fidelity is currently limited by errors introduced through the surrounding environment (i.e., radiation,...) - also having impact on the coherence time. In future we need to improve both to get to real world examples of use.

A single qubit holds the same amount of information as a single bit. In particular 1 Shannon. While a bit is a single number {0,1}, a qubit is a point on the (topological) 3-sphere. Multiple bits geometrically form the 1-skeleton of an n-cube. That is 2^n corner points. n-qubits geometrically form the n-fold tensor product of 3-spheres. The major advantage is that they have more room to move around, not that they store more information. This is analogous to integrating in one real variable versus one complex variable. Now extend this to many, many, many dimensions. All that extra space theoretically gives an advantage in finding the "correct" corner of an n-cube.

Despite exposing some weaknesses, these methods exhibit Quantum Utility, demonstrating quantum computing’s usefulness in specific applications, even if they don’t yet show a Quantum Advantage.

Quantum Machine Learning (QML) is currently navigating its developmental phase, endeavoring to ascertain its concrete utility. From my perspective, the potential of machine learning techniques to be enhanced through quantum methods, such as quantum kernels, is particularly interesting, especially when leveraging quantum simulators with capacities up to 48 qubits. However, it's important to acknowledge that utilizing such high-capacity quantum simulators would likely entail a significant computational cost. It appears that there is a gap in the development of algorithms and techniques that could more profoundly revolutionize the field. At present, the concept of a "quantum business advantage" seems achievable, albeit in a modest capacity.

Without doubt, AI is becoming less and less "artificial" and the upcoming synergy of Quantum Computing and AI will create what I call Quantum Advanced Intelligence or QAI, which will be more advanced than the intelligence of most humans. This will happen during this decade, as part of what I call the QAIMETA revolution of QAI and the Metaverse. To get there, Quantum computers will train and more efficiently run complex AI and ML models. A strong belief among the community is that Quantum Support Vector Machine could be the first ML Algorithm to benefit from Quantum Computing. This is because the potential of Quantum Computing could probably be utilised in the kernel trick used by SVM. At this time, Quantum AI is indeed struggling due to lack of supporting hardware. However, Classical AI has gone through this phase in past too. Today it's thriving due to the support received from Hardware. One day, Quantum AI can produce meaningful results too when it receives hardware support. In my opinion, we can try to aid classical AI using Quantum rather than trying to outperform it.

From my viewpoint, quantum computing is set to revolutionize AI and ML, particularly in handling complex tasks where classical computers struggle, such as Space Situational Awareness and detecting cracks in wind turbines. These applications involve processing vast, intricate data sets, a perfect fit for Quantum's superior data handling capabilities. For instance, in Space Situational Awareness, quantum computing could enhance the tracking and analysis of objects in orbit, offering more accurate predictions and collision avoidance strategies. Similarly, in the maintenance of wind turbines, quantum-enhanced AI could more effectively identify structural weaknesses, predicting maintenance needs before critical failures occur.

The fusion of ML with QC stands as one of the most promising frontiers in QC. While the potential is vast, the realization of QML has yet to reach its pinnacle. QML must harness the unique capabilities of superposition and entanglement, necessitating a paradigm shift in approach compared to classical methods to unlock its full potential. The limitations of quantum computers in handling large datasets hinder the empirical validation of QML's superiority over classical ML. It's crucial to recall that just a few years ago, many doubted the advantages of NN. While the current landscape may not fully showcase QML's superiority, the trajectory of innovation in QC hints at a future where QML will undoubtedly revolutionize the ML field.

As others have mentioned, a very promising initial candidate for bringing useful quantum computing to business applications is with quantum kernels. Although some points were not discussed yet that are relevant to bring up. First, it seems very unlikely just applying a standard kernel feature map to turn a feature vector into a higher dimension for computing the product will give any value. The main work by IBM Quantum proving exponential speed up for kernel methods was a special case due to the dataset (dlog). The better candidate is covariant quantum kernels, which also help in the exponential concentration phenomena which is a kernel analog to the famous “barren plateau” problem that’s plagued variational quantum circuits for years.

QAI & QML represent a fusion of quantum computing with AI and ML. QAI harnesses the power of qubits,leveraging their unique properties for computations beyond the capabilities of classical computers.Quantum parallelism enables qubits to exist in multiple states simultaneously,presenting opportunities for more efficient problem-solving. In QML,quantum algorithms are applied to enhance traditional ML tasks.Quantum computers with exponential speed-ups,promise accelerated processing of large datasets.Algorithms like QSVM n QNN aim to revolutionize pattern recognition n optimization.While the potential is vast,practical implementations are still in early stages,with researchers exploring the quantum advantage across various AI n ML applications.

HHL, Quantum Phase Estimation, Quantum Fourier Transform, Quantum Signal Processing, and similar algorithms have the potential to do certain ML tasks more efficiently. However, in the absence of fault tolerance this is just some theoretically sound but wishful thinking. The hardness lies in the hardware really. Current heuristics, in my opinion are hopeless, much more stuff like (variational based) quantum neural networks or such.

Quantum computing has a very different relationship with local minima. Not better or worse. Different. There is research showing quantum algorithms are much better at finding local minima for a set of situations that are very hard for classical computers to deal with. On the other hand, there is also research showing QC for neural networks is problematic because the number of local minima exponentiate as more parameters are added to the model. The complexity of thinking required is even higher given that some ML use cases are all about finding the nearest local minima, while others are explicitly about how to avoid being "trapped" by them. The upshot is that you have to think about local minima very quickly in quantum ML design.

Quantum algorithms focuses on computational procedure to run on a quantum computer. Examples of QA: Shor's, Grovers etc. Quantum Models are not actually quantum algorithm but uses quantum algorithms to simulate physical, chemical, biological and other types of system at quantum level. Ex: Quantum simulation and QML models. Shors and Grovers proved to be efficient when you compare with Big-O notation and run time. VQE which is majorly used in Quantum Chemistry and material science is remarkable than classical simulation. Real development will be observed when Quantum Processors are developed. Recently QuEra demonstrated error corrected Quantum algorithm on 48 logical qubits out of 280 physical qubits.

Based on the combination of AI and ML, quantum computing could enable entirely new classes of algorithms that surpass classical limitations. Quantum algorithms don't just speed up existing processes like search and optimization; they open the door to exploring solution with exponentially greater depth and complexity. While currently, quantum algorithms do not always illustrate superior performance over classical models, the quantum machine learning models in certain tasks outperform classical algorithms, especially, in tasks that utilize large and complex data.

By calculating the SHAP-values for classical ML and their quantum counterparts we see that QML models do have a higher capacity leading to handling more features in less training time.

Currently we are working in QML with small classical data with use of auto encoding techniques - as the step of statepreparation/encoding (amplitude, basis,...) is not trivial. The encoding must also be done to preserve the characteristics of the data and not introducing any bias to have a chance that our QML models can learn/classify it. One step for improvement might be using real quantum data and train our models with it.

This requires control and error-correction mechanisms due to their sensitivity to external disturbances. Quantum software includes the algorithms, programming languages, frameworks, and tools to develop and run applications on quantum hardware. The development of quantum hardware and software is essential for advancing in the field; especially development focused on improving qubit coherence times, scalability, and software accessibility.

Quantum processors and quantum memory, enable the execution of quantum algorithms, IBM, Google, and Rigetti are developing quantum computers that can be accessed via cloud services, making them available for practical applications. Frameworks like Qiskit, Cirq, and PennyLane provide tools for developing and testing these algorithms.

Quantum hardware as well as software has made some good progress recently. There is no clear winner among the hardware but quantum hardware companies are focusing on building application specific hardware. Software has progressed greatly because of the open source quantum libraries (like qiskit by IBM) and other community efforts like IBM Summer Schools, Xanadu CodeCamp, etc. Besides, it's easier for software engineers to migrate to quantum computing that has contributed to the progress of quantum software too.

Quantum sensors exploit the fundamental properties of atoms and light to make measurements. QML is mainly used to bridge the gap between a quantum computer and sensors. QML algorithms process the info stored in quantum computers without collapsing state. Particle-based quantum sensors are more accurate than classical devices developed through engineering or relying on chemical or electrical signals when it comes to quantifying acceleration, magnetic fields, rotation, gravity, and the passage of time. Atomic timepieces that are more precise and compact can be manufactured using them. A well known example is the development of quantum first logic clock. There is a long way to go to have proper establishment in quantum sensors domain.

Quantum hardware, including quantum processors and quantum memory, provides the physical infrastructure for implementing qubits and quantum operations. On the other and, quantum software, including programming languages, libraries, and SDKs (like Qiskit or Cirq), enables the design and execution of quantum algorithms. The co-evolution of quantum hardware and software is essential for exploiting quantum computing's full capabilities for AI and ML applications.

Continuing from above, various implementations of Quantum Gradient Descent (QGD) that might be of interest actually have a significant overhead with two qubit registers, implementation of QPE and performing some full quantum simulation circuits as well. Of course, for signigicant amount of data this scales horribly and with the current progress of AI with data at the order of 10^6 it seems reasonable to be a little bit sceptical if the current super-succesful paradigm of AI is as simple to translate to Quantum. I think it is not and this (together with numerous other arguments) is why I think that hard but small to average-sized combinatorial (0-1) optimization problems might be way more relevant for quantum.

A lot of quantum hardware companies are focussing on the amount of physical qubits with coupling and lowering their hardware error rates. With regard to quantum software and stacks there is huge effort made to foster the different communities by slack/discord channels and getting started by bootcamps, hackathons and challenges. Also a lot of effort is made to invent algorithms that circumvent the limits of the hardware (i.e. circuit cutting, dynamic circuits using inbetween measurements and results). So in my opinion both domains (hardware and software) are on a promising way for the future and I'm convinced that we are currently on the way from solving only "toy" problems to solving problems important in real world.

Everybody knows that quantum computing may be helpful for solving quantum problems. During my quantum journey, I have asked myself about the efficiency of using quantum computing with classical data instead of quantum data. Depending on the structure of the dataset, quantum techniques may not be helpful. Researchers should consider the problem's data structure. However, they are more worried about the quantum algorithm itself than how this algorithm will perform with the data. Mapping which kind of data is appropriate for quantum computing may guide us to the real benefit.

Most of the concepts in Quantum Machine Learning are borrowed/inspired from its classical counterpart. There's a belief in the community that researchers must treat QML as a different field and should work on novel original ideas rather than trying to fit classical ML concepts into it.

Just start learning about QML techniques if u already know classical ML . If not develop ur knowledge in classical ML , know the math used , understand. That's it. Develop ur knowledge along the way. It takes solid 6 months to have a good knowledge. Chill!

It is important to note that unlike other applications of quantum computing, like optimization or simulations, the benefits of quantum computing over classical machine learning can not be easily quantified. Even though QML shows high potential, the benefits are yet little understood and can't be quantified using complexity theory.

Wow, I really miss quantum neural nets in this. No mention of dissipative state QNNs at all. I know it's a futuristic niche, but man, accelerated learning, and a net able to intrinsically use quantum erasers in its learning?
